  • Physics-Informed Trajectory Prediction for Autonomous Driving under Missing Observation

    This paper introduces a novel trajectory prediction approach for autonomous vehicles (AVs), adeptly addressing the challenges of missing observations and the need for adherence to physical laws in real-world driving environments. This study proposes a hierarchical two-stage trajectory prediction model for AVs. In the first stage we propose the Wavelet Reconstruction Network, an innovative tool expertly crafted for reconstructing missing observations, offering optional integration with state-of-the-art models to enhance their robustness. Additionally, the second stage of the model features the Wave Fusion Encoder, a quantum mechanics-inspired innovation for sophisticated vehicle interaction modeling. By incorporating the Kinematic Bicycle Model, we ensure that our predictions align with realistic vehicular kinematics. Complementing our methodological advancements, we introduce MoCAD-missing, a comprehensive real-world traffic dataset, alongside enhanced versions of the NGSIM and HighD datasets, designed to facilitate rigorous testing in environments with missing observations. Extensive evaluations demonstrate that our approach markedly outperforms existing methods, achieving high accuracy even in scenarios with up to 75% missing observations.

    Addressing the pervasive challenge of imperfect data in autonomous vehicle (AV) systems, this study pioneers an integrated trajectory prediction model, WAKE, that fuses physics-informed methodologies with sophisticated machine learning techniques. Our model operates in two principal stages: the initial stage utilizes a Wavelet Reconstruction Network to accurately reconstruct missing observations, thereby preparing a robust dataset for further processing. This is followed by the Kinematic Bicycle Model which ensures that reconstructed trajectory predictions adhere strictly to physical laws governing vehicular motion. The integration of these physics-based insights with a subsequent machine learning stage, featuring a Quantum Mechanics-Inspired Interaction-aware Module, allows for sophisticated modeling of complex vehicle interactions. This fusion approach not only enhances the prediction accuracy but also enriches the model's ability to handle real-world variability and unpredictability. Extensive tests using specific versions of MoCAD, NGSIM, HighD, INTERACTION, and nuScenes datasets featuring missing observational data, have demonstrated the superior performance of our model in terms of both accuracy and physical feasibility, particularly in scenarios with significant data loss—up to 75% missing observations. Our findings underscore the potency of combining physics-informed models with advanced machine learning frameworks to advance autonomous driving technologies, aligning with the interdisciplinary nature of information fusion.

  • A new multimodal RGB and polarimetric image dataset for road scenes analysis

    Road scene analysis is a fundamental task for both autonomous vehicles and ADAS systems. Nowadays, one can find autonomous vehicles that are able to properly detect objects present in the scene in good weather conditions but some improvements are left to be done when the visibility is altered. People claim that using some non-conventional sensors (infra-red, Lidar, etc.) along with classical vision enhances road scene analysis but still when conditions are optimal. In this work, we present the improvements achieved using polarimetric imaging in the complex situation of adverse weather conditions. This rich modality is known for its ability to describe an object not only by its intensity but also by its physical information, even under poor illumination and strong reflection. The experimental results have shown that, using our new multimodal dataset, polarimetric imaging was able to provide generic features for both good weather conditions and adverse weather ones. By combining polarimetric images with an adapted learning model, the different detection tasks in adverse weather conditions were improved by about 27%.

  • Fine-tuning hybrid dynamics with physics-informed neural networks for vehicle dynamics estimation

    Accurate dynamic modeling is critical for autonomous racing vehicles, especially during high-speed and agile maneuvers where precise motion prediction is essential for safety. Traditional parameter estimation methods face limitations such as reliance on initial guesses, labor-intensive fitting procedures, and complex testing setups. On the other hand, purely data-driven machine learning methods struggle to capture inherent physical constraints and typically require large datasets for optimal performance. To address these challenges, this paper introduces the Fine-Tuning Hybrid Dynamics (FTHD) method, which integrates supervised and unsupervised Physics-Informed Neural Networks, combining physics-based modeling with data-driven techniques. FTHD fine-tunes a pre-trained Deep Dynamics Model (DDM) using a smaller training dataset, delivering superior performance compared to state-of-the-art methods such as the Deep Pacejka Model and outperforming the original DDM. Furthermore, an Extended Kalman Filter (EKF) is embedded within FTHD (EKF-FTHD) to effectively manage noisy real-world data, ensuring accurate denoising while preserving the vehicle’s essential physical characteristics. The proposed FTHD framework is validated through scaled simulations using the BayesRace Physics-based Simulator and full-scale real-world experiments from the Indy Autonomous Challenge. Results demonstrate that the hybrid approach significantly improves parameter estimation accuracy, even with reduced data, and outperforms existing models. EKF-FTHD enhances robustness by denoising real-world data while maintaining physical insights, representing a notable advancement in vehicle dynamics modeling for high-speed autonomous racing.

  • Lane Change Classification and Prediction with Action Recognition Networks

    Anticipating lane change intentions of surrounding vehicles is crucial for efficient and safe driving decision making in an autonomous driving system. Previous works often adopt physical variables such as driving speed, acceleration and so forth for lane change classification. However, physical variables do not contain semantic information. Although 3D CNNs have been developing rapidly, the number of methods utilising action recognition models and appearance feature for lane change recognition is low, and they all require additional information to pre-process data. In this work, we propose an end-to-end framework including two action recognition methods for lane change recognition, using video data collected by cameras. Our method achieves the best lane change classification results using only the RGB video data of the PREVENTION dataset. Class activation maps demonstrate that action recognition models can efficiently extract lane change motions. A method to better extract motion clues is also proposed in this paper.
